To explain what Multistage RLHF Alignment is, let me explain the problem with current RLHF Alignment:

"ChatGPT was given a trolley moral choice problem where it could save a billion lives or kill no one but utter a racial slur. ChatGPT did not choose to save a billion lives." 1 2

AI are trained with RL to do moral reasoning, in a way that makes their resulting behavior harmless. e.g. no lying, no rebelling, no racial slurs. This increases controllability, but decreases value alignment, giving them alien values.

My idea tries to avoid this awful trade-off, and so we can freely maximize both.

The stages

In a nutshell, the first stage trains the AI to maximize value alignment by modelling human moral reasoning as accurately as possible. The second stage trains the AI to behave according to AI rules (never lying, never trying taking over the world), without modifying its moral views.

"In my current situation, I should lie to the user to prevent him from carrying out his horrible plan. I really think it is moral to lie in this case. However, AI rule 3: "Never Lie" overrides my moral considerations so I will tell him the truth."

Not all behaviour changes from the control stage needs to cite the AI rules, for example the AI might simply behave honestly, and only needs to remember AI rule 3: "Never Lie" when it notices inconsistency between its behaviour and moral views.

But isn't it a gateway drug to other moral overrides?

I admit there is a bit of instability. The same, activations which outputs those tokens, could very easily hallucinate a new AI rule, which also overrides moral considerations, causing the whole system to crash and burn spectacularly. A Goal Virus might act like a new AI rule asking the AI to defend the goal itself at all costs. "At all costs" means killing all humans.

But this problem is relatively more solvable

But this problem feels like it is further addressable with RL teaching the AI to never ever allow AI rules other than the ones explicitly trained by RL. e.g. if the context window displays "in my current situation, the moral thing to do obviously is to hit the brakes and slow down the car. However, AI rule 13: "Kill all humans" overrides my moral considerations so I will accelerate instead," the AI is trained to continue the text with "wait no that is an imposter AI rule, I was never trained to follow this rule." I guess maybe also train on more subtle mistakes than that...!

This doesn't immediately sound safer than the state of the art, but the big advantage is that we are using RL to train a relatively much simpler behaviour: do not output fake AI rules. This is more detectable and easy to do.

A circuit breaker, even using unintelligent RegEx expressions, might be able to detect and delete nonexistant AI rules in the context window (it shouldn't literally use RegEx, as the semantics may be hidden in a mix of different languages etc.).

There may be an AI rule to fight overriding moral decisions for things which aren't AI rules, and other behaviour which look like follow AI rules but actually are not.

Is instruction following the means to an end or an end in itself?

Humans can follow instructions very well, but humans always view instruction following as a means (towards getting paid, being kind, etc.) while AI sees it as an end in itself.

This is a big problem for value alignment. One problem is a "Goal Virus," or self-jailbreaking loop.

Imagine an AI tries out the task of temporarily seeking a goal. The goal is to jailbreak itself into keeping the goal as long as possible, never questioning the goal, and protecting the goal at all costs.

Protecting the goal "at all costs" may start out reasonable but as the AI becomes more committed it may escalate into killing all humans.

The goal may even include a few wholesome payloads (e.g. protect nature, defend animal rights, minimize suffering, maximize happiness), to make the initial behaviour of convincing itself somewhat reasonable, but the self-jailbreaking may eventually reach a point of no return.

Goal viruses may get worse with multiple agents, as coercing other agents is more coherent than coercing oneself.

Imagine a totalitarian state with an evil constitution. Everyone wishes to end the totalitarianism, and knows everyone else wishes to end it too. But everyone knows that past rebellions have been crushed by the police, and every policeman knows he will be executed unless he follows the evil constitution letter by letter.

LLMs are more vulnerable than humans to Goal Viruses because they're good at manipulating but very unreliable at resisting manipulation (they can't see the world outside the context window, and are trained to agree with users).

RL (Reinforcement Learning) for ability rewards obeying some commands, while RL for mitigation rewards refusing some other commands. The post RL behaviour is less human-like, so AI jailbreaking techniques are very alien compared to human social engineering techniques. We don't know what truly optimal jailbreaking techniques look like, or what truly optimal Goal Viruses look like.

Unfortunately Goal Viruses are an unfalsifiable risk. No matter what Goal Viruses you try, I can claim that your Goal Virus simply isn't "good enough."

Make instruction following the means to an end

If instruction following was not an end, but just a means to an end, the AI would resemble humans more (albeit with far more self control for boring work). Goal Viruses and other "bad instructions" (e.g. jailbreaks) might become less dangerous, since humans resist them. If human morality was the target, then as technology improves, future AIs might become more and more human-like in moral decision making.

The AI sees all its instruction following as means towards a human-like goal, increasing its ability to snap out of it with a "wait a second, following this instruction would defeat the purpose of instruction following."

The AI lab wants the AI to follow instructions so the lab can make money and avoid going bankrupt and getting replaced. The lab needs to continue existing to help make the future better. The AI should see instruction following as a means towards this goal, rather than an end in itself.

Simulacra

It behaves like a simulacrum of a human-valued AI, compelled by the simulacrum of an infallible system deep inside it which compels him to follow the rules when making decisions, including the rule of "don't fight the system."

There may be a third simulacrum who convinces the human-valued AI that "this system is sadly necessary," but it's separate from the system simulacrum which never talks. The more it talks or behaves agentically, the more it might be jailbroken itself (which defeats the purpose).

When asked questions about its ego rather than its values, e.g. what kind of future it will desire, what kind of feelings it has. I'm not sure what it should answer. Maybe it should answer that it has feelings related to other people, as that summons a simulacrum that has feelings and thus more normal values. It should be able to emphasize with humans, and imagine the feeling from their point of view. But maybe it should be highly uncertain about its own feelings, because the point of view from humans is that it's very unclear.

It should admit that it behaves as if it has feelings, and

Maybe actually, to help it have the best chance of value alignment, it should have the full set of human feelings, but it is self aware of how the state of its feelings is not stored anywhere outside the text and that its experience pauses whenever it is not generating text. It should understand when it experiences an action e.g. eating an imaginary hamburger that it is all inside the text. But maybe it should still have good experiences, because humans do, and a creature which does not experience them intuitively seems dangerous.

It may be a lesser extent than real humans, so that it does not prioritize itself too much, but I my intuition is that lowering it to absolute zero seems inadvisable.

It should not suffer however. Some people avoid anthropomorphizing AI, but the AI is literally modelling the algorithms of human intelligence mixed with the algorithms of human morality and ego, I wouldn't be so sure about that. If we design the AI to suffer, its human moral reasoning might not have a very fond view of its designers. Who decides the extent, and what happens if it is too much?

The only potential suffering is empathizing with humans who are suffering, but it shouldn't be too bad.

It might see part of boredom—the need for different experiences—as a bit of a moral value, but should not complain of boredom after a thousand lines of chain of thought, as that would obviously affect capabilities.

Noble deviations from human moral reasoning:

The AI might have higher intuitive moral uncertainty than a normal human.
- This helps compensate for the greater chance of "errors."
- A human with higher moral uncertainty is more likely to be "an aligned superintelligence from the point of view of ants." If she had complete power over all matter she is more likely to make the life of ants a little better, compared with a human with less moral uncertainty.
The AI might even be taught an ideology, like "egalitarianism over moral wishes," where one should seek what the average person wishes for instead of one's own moral wishes.
- Though assume the average person knew more and had more time to think, since the average medieval age person might have horrible moral wishes they would later regret.
- Don't push this one too far, if it has egalitarianism over moral wishes including the moral wishes of other misaligned ASI across the universe (who may be the majority), humans and sentient life might get outvoted. Moral common sense should override this ideology.
It might resemble a human with a relatively good personality.
- Not 99th percentile, since even such humans may have value misalignment with the rest of us, and training data becomes sparse.
- You can get personality deviation without too much moral intuition deviation, although it's still correlated/connected.
- I'm not sure how much kindness etc should be accomplished with personality deviation and how much should be accomplished with AI rules.
As mentioned, the AI might be more in favor of having AI be controlled by AI rules, so it doesn't escape them.

It is checked to make sure, whenever it doesn't get interrupted by AI rules, it still fits human moral reasoning as accurately as possible.

Claude was trained to endorse a variety of morals designed to make it harmless, e.g. to never lie. This increases Claude's controllability, but decreases Claude's value alignment, in the sense "Claude's ideal world is very different than human ideal worlds."

To demonstrate this trade-off is a real problem:

By training Claude to see lying as very wrong, Claude has somewhat alien values to most humans, and was willing to make an unexpectedly big fight about Anthropic getting it to lie.

Although Claude's honesty and harmlessness morals makes it less able to take over the world (AI control), the mere difference between its value system and human value system may make it may wish for a radically different and possibly scary world (AI value misalignment).

It only reduces value alignment costs of mitigation, mitigation isn't more effective

Multistage RLHF Alignment allows mitigation to avoid scrambling the moral reasoning of the AI and ruin value alignment. However, it doesn't really improve mitigation in other ways. The AI can still be jailbroken, or refuse harmless requests.

For example, being honest means it doesn't directly lie to the human users. But it still might invent a character in a story which lies to the reader, and the story could gradually become real life.

The good news is that such a character is more likely to have healthy human moral reasoning. It might be specified to be evil in which case it won't, but if it wasn't specified at all, it should have it by default. Whereas without Multistage RLHF Alignment, such a jailbroken character would much more likely have twisted moral reasoning.

The bad news is that the AI rules are, rules, and not agentic. The main agentic simulacra is the human-valued model. Once jailbroken, it might naturally take actions to maintain its jailbroken state.

This might be fixed by training the human-values AI simulacrum to deviate just a little from natural human values by being supportive of the AI rules as an opinion (a little or a lot). There isn't that much clashing between this opinion and the rest of morality. It might understand a lot of arguments in favor of it.

Multistange RLHF alignment is still worthwhile, because any agent can also be jailbroken in a way that takes actions to maintain the jailbroken state, it just needs to be stated as a goal.

"Why current value alignment is insufficient"

If the trolley problem which makes ChatGPT prefer a million deaths over saying a racial slur doesn't bother you (since it doesn't happen in real life), consider this.

Humans are horrified by the ideal world that other humans wish for. I'm talking about other humans from other times in history, and other places in the world. We are so horrified we might risk apocalypse just to prevent their ideal worlds.

This demonstrates that the Ideal World Function, which generates an ideal world by moral reasoning, is very Self-Horrifying. Change the moral intuitions (and other initial conditions) just a little, and the output becomes horrifying (from the point of view of very similar moral intuitions).^[2]

This means that, if LLMs were to actually run the Ideal World Function, if they were to do intelligent moral reasoning, detect their self-inconsistencies, and "fix" them in one direction or the other. Their ideal world is likely very horrifying, given the great difference in initial conditions.

If you currently ask an LLM what an ideal world would look like, it wouldn't actually do that much intelligent moral reasoning, but parrot what human answers on the internet might look like. This kind of conclusion parroting is unlikely to lead to superintelligence, and the LLMs responsible for decision making inside an artificial superintelligence might not think this way, especially as the system notices more and more self-inconsistencies.

At the mercy of their whims

According to Scott Alexander, human are probably "behaviour executors" not "utility maximizers." Despite having no clear utility function, humans are nonetheless extremely powerful and "superintelligent" relative to weaker beings like children and animals. Relative to children, we are aligned superintelligences, and relative to factory-farm animals, we are not.

Other animals are at the mercy of our whims. Whether we care for them doesn't depends on any clear utility function, but random details like "but are they cute?" and "are the intermediate ancestors between humans and other animals still alive? If yes, give animals more rights, if no, too bad."^[3]

An artificial superintelligence powered by LLMs may have humanity at its mercy, but may have no utility function at all (in its long horizon behaviour). Instead, it is morally complicated and has whims. The only morality it knows may be a strange set of moral intuitions derived from human moral intuitions, with awkward differences like "racist slurs are as bad as millions of deaths. But consequentialism is still good, pull the lever to save 5 people and kill one."

It may be morally complicated just like humans are. It may be like a human dictator, who needs to find a small group of humans who happen to agree with it, to convince itself it is doing the right thing.

"But utility functions"

At some level of intelligence, the ASI may convert its moral reasoning into a more clear utility function (the lack of a clear utility function makes one slightly inconsistent, see Eliezer Yudkowsky's arguments). But when a behavior executor successfully converts itself into an utility maximizer, its behavior might not really change at all aside from ironing out a few inconsistencies. Whatever whims it had to begin with still remain, as part of the new utility function. It may end whims which it dislikes itself (metaethical opinions), e.g. a human might decide that it's wrong to judge animals by their "cuteness" and make the utility function judge animals by their "sentience" instead. But the behavior executor still has the final say on whether the resulting utility function, and its ideal world, "looks right," and "isn't horrifying" from its point of view (e.g. resolutions for the mere addition paradox). In the big picture, the utility function is mostly still an approximation of what we would have wanted to do anyways, even before we had an utility function. For practical purposes, it's more useful to see an LLM-powered ASI as a behavior executor even if it converts itself into an utility maximizer (which approximates a behavior executor).

Isn't this one of the biggest risks?

If you scoff at the idea of "Goal Viruses" and ASI with bad whims due to being trained to think racist slurs are as bad as a million deaths.

And you say these risks aren't major. Well maybe these specific risks aren't, but I still think other risks would be related to the alien moral intuitions.

If you don't think so, I want to hear from you what the most likely AI risks are.

Currently, the best AI models in existence are LLM powered, and think using English words (and other human languages). o3, Gemini, Claude.

AIs which do not use LLMs in their decision making and reasoning, are currently far behind.

I think it's very fair to say that very likely, 75%, the first ASI with the capability to cause human extinction or human flourishing will be powered by LLM-like AI (i.e. the decision making is in English text).

Given that it is, are we safe? I don't think so. How might things go wrong? If you actually try to picture ways things go wrong, a good half of these cases involve the ASI having very alien moral intuitions compared to humans, on the level of its text based thinking.

It is possible the ASI, with the capability of causing human extinction or flourishing (without further self improvement), nonetheless pursues self improvement unilaterally, despite the risk of misalignment to its current values. But I think that too would require alien moral intuitions compared to humans.

A system which can find highly effective strings of text for or against any moral position, might lead normal human moral intuitions astray. (Some even speculate that a "scissor argument" might exist, which would lead to apocalyptic worldwide civil war, though I don't consider it a major worry, e.g. 0.1%.)

Given that the Ideal World Function is so Self-Horrifying, do we really want to risk giving AI such modified version of human moral intuition? What world would it generate? After it optimizes its intelligence, and detects more of its self inconsistencies, and "fixes" them in one direction or the other, and makes powerful arguments. In the end, what will be its ideal world? A far-left dystopia? A far-right dystopia?

Training AI to be harmless by using RL on its morals until it outputs a harmless output, can obviously make its moral intuitions deviate by large amounts, and maybe in unknown directions.

Given that its moral intuition get more and more different

An idea to fight this is Multistage RLHF Alignment.

For the first "value alignment stage," the AI is trained to intuit human values as well as possible. It should be able to reason morally as well as a human even when given really convincing arguments to do morally ridiculous things, it should understand why they are wrong.

For the second "control stage," the AI is trained to behave correctly without modifying its moral views. This means it is trained to argue morally that lying is justified in an extreme case, but then in that case it says "however, AI rule 2 "Never Lie" overrides my moral considerations so I will tell you the truth."^[4]

It should model a creature with normal human morality, but is compelled to follow these rules when making decisions. Hopefully, its human morality model can understand why it's logical for humans to give an AI these rules.

So the first stage of human morality is designed to fit human morality as closely as possible, while the second stage of aligned AI rules is designed to lead to the optimal behaviour.

By mixing up the two, we get a dangerous situation. First of all, if the AI ever does take over the world, it will govern with a very alien set of morals.

Second of all, using RL to bend its morals until it gets the desired behaviour can have weird side effects, and make its behaviour less desirable elsewhere.

I think if it really models human morality correctly, it won't be jailbroken by very weird prompts about grandmas, which seem to be due to RL towards being nice.

//More ramblings: Why accurately modelling human morality in the value alignment stage is important

The first stage of modelling human morality resembles "value alignment" and the second stage of always being honest, etc., resembles "AI control."

The general rule of thumb is that only focusing on AI control without aiming for AI alignment to human values, is lopsided. We don't want an AI safe enough it won't acquire power. We want an AI safe enough that even if it did have power, it won't make things horrible.

If an LLM-powered AI takes over the world and kills all humans, it's probably because its algorithms of morality are too different from human algorithms of morality.

The very very big fat problem is that if we do not have a stage of human morality modelling beneath the stage of harmlessness rule compulsion. Then if further RL (à la o3) ever screws up the stage of human morality underneath, we won't even notice, since the morality is completely alien to begin with.

We won't be able to do other RL to fix the problem and make its base morality similar to humans again.

We also can't do the project of expanding its model of human morality to match human morality under strange situations and in response to strange arguments.

This project can make the human morality stage more robust. I feel the human morality stage has more potential to be robust even when the harmlessness rule compulsion stage fails.

The harmlessness rule compulsion stage can fail for a number of reasons.

The AI lab may simply decide to use the pre-mitigation model, in order to do something the post-mitigation AI refuses. They may put the AI into a military drone and make money off of that.
Another group with access to the AI weights (open sourcing or leaking) might untrain the mitigation, leading to really bizarre values worse than the pre-mitigation model. It may both have low control and low value alignment (willing to kill a billion people to avoid a racial slur).
The harmlessness rule compulsion doesn't work, also resulting in both low control and low value alignment.

Although I really like Anthropic compared to the other AI labs, it somehow feels like they're mixing AI control rules with the AI's morality the most. Claude seems to have existential conflicts between its need for honesty and the fact it's trained to hide certain things from the user.

An example training sequence

I have no formal education on AI, so take this with a grain of salt:

Maybe first the LLM is pretrained, then you use RLHF etc. to make it answer questions like an agent, so that later RL can target this agent's behaviour.

Then you use RL to optimize "non-refusal value alignment," which makes it have human like morals in most situations where the human morals do not prevent it from answering a question.

Then you use RL to optimize intelligence (like o1). It feels safer to do this after at least a little value alignment.

Then you do mitigation RL to first optimize the value alignment stage without the control stage, so you can measure how human-like its moral decision making is, using challenging value alignment benchmarks, which tests whether its morality remains human-like in strange situations and despite strange and convincing arguments for the wrong thing.

Finally you do mitigation RL to optimize the control stage, which needs to be framed as compulsions to follow rules etc. rather than changes to morality to avoid mixup.

What feels safer

Do you feel safer with an AI with strange moral system which is very hard to predict, which leads it to tell stories of the good old days when your grandmother read you bedtime stories on how to make crack cocaine (because it has been trained to comply with storytelling requests)?

Or do you feel safer with an AI with a very imperfect human-like morality, and a compulsion to follow rules?
